Avoid using any cleaning wipes or solutions containing alcohol, since the alcohol will dry out and damage the rubber. Other ingredients to avoid include acetone, bleach, and oil-based products. Refrain from running or soaking your rubber stamp in hot water.

Soap and Water or Stamp Cleaner: Most non-staining inks can be washed off using mild soapy water (a small amount of dish washing detergent mixed in water is fine). A clean toothbrush is great for washing off ink that has become embedded in nooks or crannies in your rubber stamp.

If you have a stamp that is really dirty and wont come clean with wipes, take an old toothbrush (soft) and dip it in some vegetable oil and scrub it. Then spray it with an off the shelf stamp cleaner to remove the oily residue and wipe with a baby wipe. Make sure you get all the oil off or the stamp will get sticky.
